Into what components does the bias-variance decomposition in machine learning split the generalization error?

For regression the expected error decomposes into the squared bias, the variance, and irreducible noise, where bias reflects a systematic error from an overly strong model assumption and variance reflects sensitivity to perturbations in the training set. Reducing bias usually needs a more complex model, while reducing variance needs more data or regularization, and the two often trade off.

What problems arise in gradient descent when the learning rate is too large or too small?

A too-large learning rate makes parameter steps overshoot the optimum so the loss oscillates or even diverges near the minimum, while a too-small rate yields tiny updates that converge extremely slowly and can stall in flat regions. In practice learning-rate decay or adaptive optimizers such as Adam help balance the two.

What is the essential difference between L1 and L2 regularization in constraining model parameters?

L2 regularization (ridge) penalizes the squared sum of parameters, shrinking them toward but not exactly to zero for a smoother model, while L1 (lasso) penalizes their absolute sum and sparsifies the solution, driving unimportant feature weights exactly to zero for feature selection. Geometrically the L1 constraint region has corners, so the optimum more often lands on an axis.

What is overfitting of a model, and what are its intuitive signs?

Overfitting happens when a model performs extremely well on training data but much worse on unseen test data, having memorized noise as if it were a real pattern. The intuitive sign is a very low training error paired with a much higher validation error, a large gap between the two.

What roles do the training, validation, and test sets each play?

The training set fits the model parameters, the validation set selects hyperparameters and monitors overfitting during training, and the test set is used only at the end to estimate true generalization. The test set must never take part in training or tuning, or the performance estimate becomes optimistic.

What is the core difference between supervised and unsupervised learning?

Supervised learning trains on labeled examples to learn a mapping from inputs to outputs such as classification or regression, while unsupervised learning works on unlabeled data to discover its underlying distribution or structure like clustering or dimensionality reduction. The essential difference is whether the training data provide the desired outputs.

What role does information gain play when a decision tree splits a node?

Information gain equals the reduction in entropy before and after a split, measuring how much a feature lowers uncertainty. Algorithms such as ID3 pick at each node the feature with the largest gain, making the resulting subsets as pure as possible.

How does k-fold cross-validation assess a model's generalization ability?

The data is split into k similarly sized folds; each time k-1 folds train the model and the remaining fold validates it, repeated k times, and the validation scores are averaged. Every sample thus serves in both training and validation, giving a more robust estimate of generalization when data is limited.
